QuantXRL: OpenEnv-Compatible Trading Environment

A production-grade, realistic quantitative trading environment for reinforcement learning agents. Supports portfolio optimization, algorithmic trading, and market-making strategies with professional-grade risk management and technical analysis.

Overview

QuantitativeTrading-v1 is a fully functional OpenEnv-compatible environment that simulates realistic trading scenarios with:

  • Multi-asset portfolio management with position tracking and risk limits
  • Professional trading mechanics including slippage, commission, and leverage constraints
  • Technical indicators (RSI, MACD, Bollinger Bands, ATR, Moving Averages)

Installation

Prerequisites

  • Python 3.8+
  • pip or conda

Local Installation

State Space

State Vector (Normalized)

The environment returns a normalized 64-dimensional state vector:

Feature Details

Portfolio Features

  • cash_ratio: Cash / Initial Capital (0-1)
  • leverage: Total Position Value / Portfolio Value (0-5)
  • num_positions: Count of open positions
  • has_positions: Binary flag

Market Features (per asset)

  • price: Current normalized price (price / 100)
  • return: Daily log return
  • volatility: Rolling annualized volatility

Technical Features (per asset)

  • rsi: Relative Strength Index (0-100, normalized to 0-1)
  • macd: MACD value (normalized)
  • atr: Average True Range (normalized)
  • bb_upper: Bollinger Band upper band (normalized)

Position Features (per position)

  • quantity: Position size (normalized)
  • entry_price: Entry price (normalized)
  • pnl_pct: Unrealized P&L percentage

Normalization

States are normalized using robust scaling:

z = (x - median) / (MAD + 1e-8)
z = clip(z, -10, 10)

This approach is robust to outliers and preserves information.


Action Space

Discrete Actions

Each action specifies:

  • Symbol: Which asset to trade
  • OrderType: BUY (1), SELL (-1), or HOLD (0)
  • Quantity: Number of shares (0-100)

Action Constraints

  • Minimum Order Size: 1 share (configurable)
  • Maximum Position Size: 25-50% of portfolio
  • Max Leverage: 2-5x (configurable)
  • Quantity Validation: Non-negative quantities only

Reward Function

Composite Reward (Multi-objective Optimization)

R(t) = 0.6 * return_component + 0.2 * risk_penalty + 0.2 * trade_efficiency

Components

  1. Return Component (60%)

    • Daily return scaled by 100
    • R_return = (V_t - V_{t-1}) / V_{t-1} * 100
    • Range: [-10, +10]
  2. Risk Penalty (20%)

    • Drawdown penalty: -5 * (max_value - current_value) / max_value
    • Encourages capital preservation
    • Range: [-5, 0]
  3. Trade Efficiency (20%)

    • Reward from closing profitable trades
    • Last 5 closed trade PnLs averaged
    • Trade_efficiency = mean(pnl_5trades) * 0.01
    • Range: [-0.5, +0.5]

Tasks and Difficulty Levels

Easy Task: EasyTrade

Goal: Achieve positive returns on a single asset with low volatility.

Characteristics:

  • Single asset reduces complexity
  • Long episode allows for trend-following
  • Low costs and leverage constraints
  • Suitable for: Baseline agents, simple heuristics

Medium Task: MediumTrade

Goal: Manage a portfolio of 3 assets with rebalancing.

  • Requires allocation optimization
  • Moderate frequency (daily rebalancing)

Hard Task: HardTrade

Goal: High-frequency trading with tight risk controls.

Takes random actions for benchmarking.

Q: How do I use this with my RL algorithm?

A: The environment follows standard OpenAI Gym API:
