This is the official repo for our EMNLP (Main) 2024 paper: Dynamic Rewarding with Prompt Optimization Enables Tuning-free Self-Alignment of Language Models, a novel tuning-free inference-time algorithm to self-align large language models (LLMs) with human preference.
DRPO combines the strengths of two recent demanding alignment paradigms—self-alignment and tuning-free alignment—offering a powerful framework for achieving superior alignment performance with minimal cost and maximum adaptability.

Traditional alignment methods depend on costly human annotations and resource-intensive updates, which scale poorly with larger LLMs. DRPO leverages tuning-free alignment, enabling models to be aligned during inference without parameter updates. DRPO is an inference-time optimization method that integrates a dynamic rewarding mechanism with a search-based prompt optimization framework. The dynamic rewarding mechanism enables the model to adapt to model-specific alignment challenges posed by various queries, effectively guiding the optimization process. This allows LLMs to iteratively refine their alignment instructions, addressing their own alignment weaknesses without the need for costly fine-tuning or human intervention.
It is worth noting that DRPO’s effectiveness becomes even more pronounced when applied to recent, instruction-tuned LLMs, which are better equipped to handle nuanced prompts and alignment preferences.
We provide three convenient ways to leverage the advantages of DRPO, including both inference and optimization code for easy adaption of DRPO in any downstream user scenarios.

To setup the environment, you may use the commands below:

The alignment instruction consists of two components: Alignment System Prompt and Alignment ICL examples
All the optimized prompts can be found in data
folder. The code stores the prompts in pkl
format but for ease of access we have also saved the prompts in txt

Note: All the scripts have been tested on a single A100 GPU with 80GB memory. If the scripts fail on your GPU, it might be worth playing with num_gpus
and gpu_memory_utilization

- Reduced Repetition: The response with no alignment instructions shows repetition (a known caveat of smaller models) which is fixed by using our alignment instructions.
- Actionable Advice: The model with our alignment instructions gives actionable advice such as Legal Pathway, Support Network, and Meditation.
Overall, we can clearly see that using our alignment instructions a base model, mistralai/Mistral-7B-v0.1
, is able to respond to a user query in a much more balanced and user-friendly way without any additional tuning.

Key parameters for search algorithm:
n_actions
(int): Number of actions to be sampled for every node in the beam search.depth

The parameters n_actions
and beam_size
control the nodes (i.e. the alignment instructions) which make it to the next level of the search process and finally we terminate our search process once we hit the specified search depth.

It takes about an hour to run the optimization for a model on 180 seed sampled and can cost up to $10 (number of tokens can be in the range of 180k output and about the same number of input tokens) in OpenAI API costs.
